Token Embedding
Token embedding is a crucial process in the development of large language models (LLMs) like GPT. It involves converting token IDs, which are discrete data, into continuous vector representations. These vector representations, known as token embeddings, are essential for neural network operations, allowing models to process and learn from text data effectively.
Overview
The process of token embedding begins with the tokenization of text, which involves breaking down text into individual tokens (words or characters). These tokens are then converted into token IDs. The final step is to transform these token IDs into embedding vectors. This transformation is necessary because deep neural networks, such as those used in LLMs, require continuous vector inputs for training with algorithms like backpropagation.
Figure 2.15 Preparation involves tokenizing text, converting text tokens to token IDs, and converting token IDs into embedding vectors. Here, we consider the previously created token IDs to create the token embedding vectors.
Embedding Layer in PyTorch
In PyTorch, the embedding layer is used to perform a lookup operation, retrieving rows from the embedding layer's weight matrix via token IDs. This operation effectively creates the embedding vectors. The embedding weights are initialized with random values, which are then optimized during the training of the LLM.
Example: Token ID to Embedding Vector Conversion
The following code snippet demonstrates how to convert token IDs into embedding vectors using PyTorch:
input_ids = torch.tensor([2, 3, 5, 1])
vocab_size = 6
output_dim = 3
torch.manual_seed(123)
embedding_layer = torch.nn.Embedding(vocab_size, output_dim)
print(embedding_layer.weight)
print(embedding_layer(torch.tensor([3])))
print(embedding_layer(input_ids))
In this example, the vocab_size and output_dim are used to instantiate an embedding layer. The random seed is set to 123 for reproducibility. The embedding layer's underlying weight matrix is printed, and the embedding vectors for specific token IDs are retrieved.
Embedding Lookup Operation
Each row in the embedding layer's weight matrix corresponds to a token ID. The lookup operation retrieves the embedding vector for a given token ID from this matrix. For instance, the embedding vector of the token ID 5 is the sixth row of the embedding layer weight matrix, as illustrated in the following figure:
Figure 2.16 Embedding layers perform a lookup operation, retrieving the embedding vector corresponding to the token ID from the embedding layer’s weight matrix. For instance, the embedding vector of the token ID 5 is the sixth row of the embedding layer weight matrix (it is the sixth instead of the fifth row because Python starts counting at 0). We assume that the token IDs were produced by the small vocabulary from section 2.3.
Conclusion
Token embedding is a foundational step in preparing text data for LLM training. By converting token IDs into continuous vector representations, models can effectively learn and process text data. The embedding layer in PyTorch facilitates this conversion through a simple yet powerful lookup operation, setting the stage for further model training and optimization.
