LQ-LoRA is a parameter-efficient fine-tuning method that decomposes each pretrained matrix into a high-precision low-rank component and a memory-efficient quantized component. It addresses a limitation of applying conventional LoRA to quantized weights: the quantized matrix can differ substantially from the original, while standard LoRA initialization does not use the matrix’s structure. section 8.3 section 8.3.6
The method separates decomposition, quantization, and adaptation:
- Factorizes the pretrained matrix so the low-rank component captures high-variance directions while the other component remains suitable for quantization. section 8.3.6
- Uses an iterative procedure that alternates between optimizing the low-rank component and the quantized component to improve reconstruction. section 8.3.6
- Applies randomized SVD for low-rank approximation, followed by quantization of the second component. section 8.3.6
- Keeps the quantized component constant during fine-tuning and updates only the high-precision low-rank component. section 8.3.6
Practical method choice
Choose LQ-LoRA when a hybrid representation is useful: the quantized component reduces memory usage, while the trainable low-rank component preserves an adaptation path. Compare it with LoRA, QLoRA, QA-LoRA, and DoRA according to memory limits, convergence needs, and performance retention. section 8.3.7
